Question 2

Why do gradients sometimes 'explode' in deep networks during backpropagation?

Accepted Answer

Because gradients are multiplied through many layers via the chain rule, causing exponential growth

Gradients become complex-valued during backpropagation

Answer

Gradients remain constant and learning stops after the first epoch

Question 5

What is gradient norm clipping, and how does it differ from gradient value clipping?

Accepted Answer

Norm clipping scales all gradients proportionally preserving direction; value clipping clips each element independently

They are identical in effect but use different PyTorch function names

Answer

Norm clipping is used in CNNs; value clipping is used in RNNs

Question 6

What is the main drawback of gradient value clipping compared to gradient norm clipping?

Accepted Answer

It clips each element independently, potentially distorting the gradient direction

Answer

During the forward pass, inside the model's forward() method

Question 13

What does the max_norm parameter in clip_grad_norm_() represent?

The threshold for the total L2 norm; gradients are scaled down proportionally if the norm exceeds it

Answer

The maximum value any single gradient element is allowed to have

Answer

The maximum number of gradient update steps before stopping

Answer

The maximum learning rate the optimizer is allowed to use

Question 14

Does gradient norm clipping change the direction of the gradient vector in parameter space?

Accepted Answer

No, it multiplies all gradient components by the same scalar, preserving their direction

Answer

Yes, it rotates the gradient toward dimensions with the steepest loss curvature

Answer

Yes, because it zeros out gradient components that exceed the threshold

Answer

It depends on whether the optimizer uses momentum or not

Question 15

Does gradient value clipping preserve the direction of the gradient vector?

Accepted Answer

No, because each component is clipped independently, changing relative proportions and thus the direction

Answer

Yes, because all components are bounded symmetrically by the same clip_value

Answer

Yes, as long as the clip_value is the same positive number for all layers

Answer

Only when the gradient norm is already exactly equal to the clip_value

Question 16

Why is a max_norm of 1.0 a popular default choice for gradient clipping in practice?

Accepted Answer

Because it prevents large gradient spikes while still allowing learning; it is an empirically safe default

Answer

Because randomly initialized networks always have gradient norms of exactly 1.0

Answer

Because it equals the default learning rate used in PyTorch's Adam optimizer

Answer

Because values above 1.0 are mathematically proven to always cause divergence

Question 17

What is the mathematical formula for gradient norm clipping?

Accepted Answer

g' = g × min(1, θ / ||g||₂)

Answer

g' = g − sign(g) × max(0, |g| − θ) applied element-wise

Answer

g' = g / ||g||₂ always, regardless of threshold

Answer

g' = clip(g, −θ, θ) applied independently to each element

Question 18

What does the clip_value argument in PyTorch's clip_grad_value_() control?

Accepted Answer

The absolute boundary applied independently to each gradient element

Answer

The maximum allowed L2 norm of the combined gradient vector

Answer

The fraction of gradient elements to randomly set to zero

Answer

The uniform scale factor applied to all gradients

Question 19

How do gradient clipping and learning rate work together to control the size of parameter updates?

Accepted Answer

Together they bound the maximum parameter update: clip_threshold × learning_rate

Answer

Gradient clipping replaces the learning rate in controlling parameter step size

Answer

They are completely independent; clipping does not affect how learning rate scales updates

Answer

Clipping automatically reduces the learning rate each time it is triggered

Question 20

What does torch.nn.utils.clip_grad_norm_() return, and why is logging this value useful?

Accepted Answer

The total L2 norm of all gradients before clipping was applied

Answer

The gradient tensor for the first parameter after clipping

Answer

Answer

The number of gradient elements that were actually modified by clipping

Question 21

How can you log gradient norms during training to check whether clipping is being triggered?

Accepted Answer

By logging the return value of clip_grad_norm_(), which gives the pre-clip L2 norm

Answer

By checking whether the loss is decreasing after each batch

Answer

By comparing model weights before and after each optimizer.step() call

Answer

By counting the number of NaN values that appear in model outputs

Question 22

What is the difference between global norm clipping and per-layer norm clipping?

Accepted Answer

Global norm uses one norm across all parameters; per-layer clips each layer using its own separate norm

Answer

Global norm clips all parameters to the same absolute maximum value; per-layer uses different max values

Answer

Global norm is faster but less accurate; per-layer gives better convergence in practice

Answer

Per-layer clipping is the PyTorch default; global norm requires writing custom code

Question 23

Do Long Short-Term Memory (LSTM) networks eliminate the need for gradient clipping?

Accepted Answer

No, while LSTMs reduce vanishing gradients, exploding gradients can still occur and clipping is still needed

Answer

Yes, LSTM gates completely eliminate both vanishing and exploding gradient problems

Answer

Yes, but only for sequences shorter than 100 time steps

Answer

No, LSTMs actually make gradient explosion worse than vanilla RNNs

Question 24

What gradient norm value strongly suggests a model is experiencing gradient explosion?

Accepted Answer

A gradient norm orders of magnitude larger than the threshold, or NaN appearing in loss values

Answer

A gradient norm close to but slightly below the clipping threshold

A gradient norm equal to the total number of trainable parameters

Question 25

How does sequence length in an RNN affect the severity of gradient explosion?

Accepted Answer

Gradient norms grow exponentially with sequence length when the weight matrix eigenvalue exceeds 1

Answer

Longer sequences dilute gradients by averaging over more steps, reducing explosion risk

Question 27

What happens to training when the gradient clipping threshold is set too small, such as 0.0001?

Accepted Answer

Learning is severely slowed because updates are always tiny, mimicking vanishing gradients

Answer

The model trains faster because gradient updates are always tightly controlled

Accepted Answer

Yes, gradient clipping is standard in transformer training to handle occasional gradient spikes

Answer

No, transformer self-attention mechanisms fully prevent all gradient explosion problems

Answer

Only in the earliest transformer models; modern ones like GPT-4 no longer require clipping

Answer

Yes, but only applied to the positional embedding layers, not attention or feed-forward layers

Question 30

What is the key behavioral difference between clip_grad_norm_(params, 1.0) and clip_grad_value_(params, 1.0)?

Accepted Answer

clip_grad_norm_ scales all gradients together preserving direction; clip_grad_value_ clips each element independently, potentially changing direction

Answer

They produce identical results whenever the max_norm and clip_value numbers are equal

Answer

clip_grad_norm_ operates per-layer; clip_grad_value_ operates globally across all layers

Answer

clip_grad_value_ is recommended for transformers; clip_grad_norm_ should be used only for RNNs
